Vision Transformers

Vision Transformers (ViT) are a type of neural network architecture primarily used for image recognition tasks. They represent a significant evolution in the field of computer vision, applying the transformer architecture—previously successful in natural language processing—to image analysis tasks.

ViTs can be applied to a broad range of image-related tasks beyond simple classification, including object detection, semantic segmentation, and more. Due to their reliance on the transformer architecture, they can efficiently scale with increased data and computational power, often surpassing the performance of convolutional neural networks (CNNs) in large-scale image recognition tasks.

How do Vision Transformers Work?​

Unlike traditional CNNs, ViTs treat an image as a sequence of patches and use a self-attention mechanism to capture both local and global features across these patches, which can enhance their ability to handle complex visual tasks.

Patch Embedding​

The first step in a vision transformer is to reshape the input image. An image is divided into a grid of fixed-size patches (e.g., 16x16 pixels each). Each patch is then flattened into a one-dimensional vector. These vectors are linearly transformed through a trainable embedding matrix to project them into a higher-dimensional space. This step converts spatial image patches into a form that a transformer can process, akin to converting words into embeddings in NLP.

Positional Encoding​

Since transformers do not inherently process the order of input sequences, positional encodings are added to the patch embeddings to retain positional information. This is done so that the model can leverage the spatial relationships between patches, which is crucial for understanding images where the arrangement of objects and features carries significant meaning.

Transformer Encoder​

The transformer encoder in ViTs consists of alternating layers of multi-head self-attention and position-wise fully connected feed-forward networks. Each layer includes residual connections and is followed by layer normalization.

  • Multi-head Self-attention: This component allows the model to focus on different segments of the image for a comprehensive understanding. It computes attention scores based on the query, key, and value matrices derived from the patch embeddings. This mechanism enables the model to dynamically focus on the most relevant parts of the image relative to other parts.
  • Feed-forward Networks: These networks apply transformations to the output of the attention mechanism. They are typically composed of two linear transformations with a non-linearity (like ReLU or GELU) in between.

The output of the final transformer layer typically connects to a classification token (often initialized and prepended to the sequence of patch embeddings) that aggregates information from across the patches to make a prediction.

Classifier​

After processing through the transformer encoder, the representation associated with the classification token is used to make a prediction, typically via a simple linear layer that maps the transformer output to the number of classes in the classification task.
